The Power of Parallel Processing

At their core, GPUs are highly parallel processors designed to handle thousands of concurrent threads efficiently. This architecture makes them well-suited for the computationally intensive tasks involved in training deep learning models, including LLMs. The CUDA platform, developed by NVIDIA, provides a software environment that allows developers to harness the full potential of these GPUs, enabling them to write code that can leverage the parallel processing capabilities of the hardware.
Accelerating LLM Training with GPUs and CUDA.

Training large language models is a computationally demanding task that requires processing vast amounts of text data and performing numerous matrix operations. GPUs, with their thousands of cores and high memory bandwidth, are ideally suited for these tasks. By leveraging CUDA, developers can optimize their code to take advantage of the parallel processing capabilities of GPUs, significantly reducing the time required to train LLMs.

For example, the training of GPT-3, one of the largest language models to date, was made possible through the use of thousands of NVIDIA GPUs running CUDA-optimized code. This allowed the model to be trained on an unprecedented amount of data, leading to its impressive performance in natural language tasks.

import torch
import torch.nn as nn
import torch.optim as optim
from transformers import GPT2LMHeadModel, GPT2Tokenizer

# Load pre-trained GPT-2 model and tokenizer
model = GPT2LMHeadModel.from_pretrained('gpt2')
tokenizer = GPT2Tokenizer.from_pretrained('gpt2')

# Move model to GPU if available
device = torch.device("cuda" if torch.cuda.is_available() else "cpu")
model = model.to(device)

# Define training data and hyperparameters
train_data = [...] # Your training data
batch_size = 32
num_epochs = 10
learning_rate = 5e-5

# Define loss function and optimizer
criterion = nn.CrossEntropyLoss()
optimizer = optim.Adam(model.parameters(), lr=learning_rate)

# Training loop
for epoch in range(num_epochs):
for i in range(0, len(train_data), batch_size):
# Prepare input and target sequences
inputs, targets = train_data[i:i+batch_size]
inputs = tokenizer(inputs, return_tensors="pt", padding=True)
inputs = inputs.to(device)
targets = targets.to(device)

# Forward pass
outputs = model(**inputs, labels=targets)
loss = outputs.loss

# Backward pass and optimization
optimizer.zero_grad()
loss.backward()
optimizer.step()

print(f'Epoch {epoch+1}/{num_epochs}, Loss: {loss.item()}')

In this example code snippet, we demonstrate the training of a GPT-2 language model using PyTorch and the CUDA-enabled GPUs. The model is loaded onto the GPU (if available), and the training loop leverages the parallelism of GPUs to perform efficient forward and backward passes, accelerating the training process.

CUDA-Accelerated Libraries for Deep Learning

In addition to the CUDA platform itself, NVIDIA and the open-source community have developed a range of CUDA-accelerated libraries that enable efficient implementation of deep learning models, including LLMs. These libraries provide optimized implementations of common operations, such as matrix multiplications, convolutions, and activation functions, allowing developers to focus on the model architecture and training process rather than low-level optimization.

One such library is cuDNN (CUDA Deep Neural Network library), which provides highly tuned implementations of standard routines used in deep neural networks. By leveraging cuDNN, developers can significantly accelerate the training and inference of their models, achieving performance gains of up to several orders of magnitude compared to CPU-based implementations.

import torch
import torch.nn as nn
import torch.nn.functional as F
from torch.cuda.amp import autocast

class ResidualBlock(nn.Module):
def __init__(self, in_channels, out_channels, stride=1):
super().__init__()
self.conv1 = nn.Conv2d(in_channels, out_channels, kernel_size=3, stride=stride, padding=1, bias=False)
self.bn1 = nn.BatchNorm2d(out_channels)
self.conv2 = nn.Conv2d(out_channels, out_channels, kernel_size=3, stride=1, padding=1, bias=False)
self.bn2 = nn.BatchNorm2d(out_channels)
self.shortcut = nn.Sequential()
if stride != 1 or in_channels != out_channels:
self.shortcut = nn.Sequential(
nn.Conv2d(in_channels, out_channels, kernel_size=1, stride=stride, bias=False),
nn.BatchNorm2d(out_channels))

def forward(self, x):
with autocast():
out = F.relu(self.bn1(self.conv1(x)))
out = self.bn2(self.conv2(out))
out += self.shortcut(x)
out = F.relu(out)
return out

In this code snippet, we define a residual block for a convolutional neural network (CNN) using PyTorch. The autocast context manager from PyTorch's Automatic Mixed Precision (AMP) is used to enable mixed-precision training, which can provide significant performance gains on CUDA-enabled GPUs while maintaining high accuracy. The F.relu function is optimized by cuDNN, ensuring efficient execution on GPUs.

Multi-GPU and Distributed Training for Scalability

As LLMs and deep learning models continue to grow in size and complexity, the computational requirements for training these models also increase. To address this challenge, researchers and developers have turned to multi-GPU and distributed training techniques, which allow them to leverage the combined processing power of multiple GPUs across multiple machines.

CUDA and associated libraries, such as NCCL (NVIDIA Collective Communications Library), provide efficient communication primitives that enable seamless data transfer and synchronization across multiple GPUs, enabling distributed training at an unprecedented scale.

</pre>
import torch.distributed as dist

from torch.nn.parallel import DistributedDataParallel as DDP

# Initialize distributed training
dist.init_process_group(backend='nccl', init_method='...')
local_rank = dist.get_rank()
torch.cuda.set_device(local_rank)

# Create model and move to GPU
model = MyModel().cuda()

# Wrap model with DDP
model = DDP(model, device_ids=[local_rank])

# Training loop (distributed)
for epoch in range(num_epochs):
for data in train_loader:
inputs, targets = data
inputs = inputs.cuda(non_blocking=True)
targets = targets.cuda(non_blocking=True)

outputs = model(inputs)
loss = criterion(outputs, targets)

optimizer.zero_grad()
loss.backward()
optimizer.step()

In this example, we demonstrate distributed training using PyTorch's DistributedDataParallel (DDP) module. The model is wrapped in DDP, which automatically handles data parallelism, gradient synchronization, and communication across multiple GPUs using NCCL. This approach enables efficient scaling of the training process across multiple machines, allowing researchers and developers to train larger and more complex models in a reasonable amount of time.

Deploying Deep Learning Models with CUDA

While GPUs and CUDA have primarily been used for training deep learning models, they are also crucial for efficient deployment and inference. As deep learning models become increasingly complex and resource-intensive, GPU acceleration is essential for achieving real-time performance in production environments.

NVIDIA's TensorRT is a high-performance deep learning inference optimizer and runtime that provides low-latency and high-throughput inference on CUDA-enabled GPUs. TensorRT can optimize and accelerate models trained in frameworks like TensorFlow, PyTorch, and MXNet, enabling efficient deployment on various platforms, from embedded systems to data centers.

import tensorrt as trt

# Load pre-trained model
model = load_model(...)

# Create TensorRT engine
logger = trt.Logger(trt.Logger.INFO)
builder = trt.Builder(logger)
network = builder.create_network()
parser = trt.OnnxParser(network, logger)

# Parse and optimize model
success = parser.parse_from_file(model_path)
engine = builder.build_cuda_engine(network)

# Run inference on GPU
context = engine.create_execution_context()
inputs, outputs, bindings, stream = allocate_buffers(engine)

# Set input data and run inference
set_input_data(inputs, input_data)
context.execute_async_v2(bindings=bindings, stream_handle=stream.ptr)

# Process output
# ...

In this example, we demonstrate the use of TensorRT for deploying a pre-trained deep learning model on a CUDA-enabled GPU. The model is first parsed and optimized by TensorRT, which generates a highly optimized inference engine tailored for the specific model and hardware. This engine can then be used to perform efficient inference on the GPU, leveraging CUDA for accelerated computation.

Conclusion

The combination of GPUs and CUDA has been instrumental in driving the advancements in large language models, computer vision, speech recognition, and various other domains of deep learning. By harnessing the parallel processing capabilities of GPUs and the optimized libraries provided by CUDA, researchers and developers can train and deploy increasingly complex models with high efficiency.

As the field of AI continues to evolve, the importance of GPUs and CUDA will only grow. With even more powerful hardware and software optimizations, we can expect to see further breakthroughs in the development and deployment of  AI systems, pushing the boundaries of what is possible.

The evolution of generative AI is not just reshaping our interaction and experiences with computing devices, it is also redefining the core computing as well. One of the key drivers of the transformation is the need to operate generative AI on devices with limited computational resources. This article discusses the challenges this presents and how neural processing units (NPUs) are emerging to solve them. Additionally, the article introduces some of the latest NPU processors that are leading the way in this field.

Challenges of On-device Generative AI Infrastructure

Generative AI, the powerhouse behind image synthesis, text generation, and music composition, demands substantial computational resources. Conventionally, these demands have been met by leveraging the vast capabilities of cloud platforms. While effective, this approach comes with its own set of challenges for on-device generative AI, including reliance on constant internet connectivity and centralized infrastructure. This dependence introduces latency, security vulnerabilities, and heightened energy consumption.

The backbone of cloud-based AI infrastructure largely relies on central processing units (CPUs) and graphic processing units (GPUs) to handle the computational demands of generative AI. However, when applied to on-device generative AI, these processors encounter significant hurdles. CPUs are designed for general-purpose tasks and lack the specialized architecture needed for efficient and low-power execution of generative AI workloads. Their limited parallel processing capabilities result in reduced throughput, increased latency, and higher power consumption, making them less ideal for on-device AI. On the hand, while GPUs can excel in parallel processing, they are primarily designed for graphic processing tasks. To effectively perform generative AI tasks, GPUs require specialized integrated circuits, which consume high power and generate significant heat. Moreover, their large physical size creates obstacles for their use in compact, on-device applications.

The Emergence of Neural Processing Units (NPUs)

In response to the above challenges, neural processing units (NPUs) are emerging as transformative technology for implementing generative AI on devices. The architecture of NPUs is primarily inspired by the human brain's structure and function, particularly how neurons and synapses collaborate to process information. In NPUs, artificial neurons act as the basic units, mirroring biological neurons by receiving inputs, processing them, and producing outputs. These neurons are interconnected through artificial synapses, which transmit signals between neurons with varying strengths that adjust during the learning process. This emulates the process of synaptic weight changes in the brain. NPUs are organized in layers; input layers that receive raw data, hidden layers that perform intermediate processing, and output layers that generate the results. This layered structure reflects the brain's multi-stage and parallel information processing capability. As generative AI is also constructed using a similar structure of artificial neural networks, NPUs are well-suited for managing generative AI workloads. This structural alignment reduces the need for specialized integrated circuits, leading to more compact, energy-efficient, fast, and sustainable solutions.

Addressing Diverse Computational Needs of Generative AI

Generative AI encompasses a wide range of tasks, including image synthesis, text generation, and music composition, each with its own set of unique computational requirements. For instance, image synthesis heavily relies on matrix operations, while text generation involves sequential processing. To effectively cater to these diverse computational needs, neural processing units (NPUs) are often integrated into System-on-Chip (SoC) technology alongside CPUs and GPUs.

Each of these processors offers distinct computational strengths. CPUs are particularly adept at sequential control and immediacy, GPUs excel in streaming parallel data, and NPUs are finely tuned for core AI operations, dealing with scalar, vector, and tensor math. By leveraging a heterogeneous computing architecture, tasks can be assigned to processors based on their strengths and the demands of the specific task at hand.

NPUs, being optimized for AI workloads, can efficiently offload generative AI tasks from the main CPU. This offloading not only ensures fast and energy-efficient operations but also accelerates AI inference tasks, allowing generative AI models to run more smoothly on the device. With NPUs handling the AI-related tasks, CPUs and GPUs are free to allocate resources to other functions, thereby enhancing overall application performance while maintaining thermal efficiency.

Real World Examples of NPUs

The advancement of NPUs is gaining momentum. Here are some real-world examples of NPUs:

  • Hexagon NPUs by Qualcomm is specifically designed for accelerating AI inference tasks at low power and low resource devices. It is built to handle generative AI tasks such as text generation, image synthesis, and audio processing. The Hexagon NPU is integrated into Qualcomm’s Snapdragon platforms, providing efficient execution of neural network models on devices with Qualcomm AI products.
  • Apple's Neural Engine is a key component of the A-series and M-series chips, powering various AI-driven features such as Face ID, Siri, and augmented reality (AR). Large Language Models (LLMs) are capable of understanding and generating human-like text, making them invaluable for a wide range of applications, such as chatbots, content generation, and language translation.

However, deploying LLMs can be a challenging task due to their immense size and computational requirements. Kubernetes, an open-source container orchestration system, provides a powerful solution for deploying and managing LLMs at scale. In this technical blog, we'll explore the process of deploying LLMs on Kubernetes, covering various aspects such as containerization, resource allocation, and scalability.

Understanding Large Language Models

Before diving into the deployment process, let's briefly understand what Large Language Models are and why they are gaining so much attention.

Large Language Models (LLMs) are a type of neural network model trained on vast amounts of text data. These models learn to understand and generate human-like language by analyzing patterns and relationships within the training data. Some popular examples of LLMs include GPT (Generative Pre-trained Transformer), BERT (Bidirectional Encoder Representations from Transformers), and XLNet.

LLMs have achieved remarkable performance in various NLP tasks, such as text generation, language translation, and question answering. However, their massive size and computational requirements pose significant challenges for deployment and inference.

Why Kubernetes for LLM Deployment?

Kubernetes is an open-source container orchestration platform that automates the deployment, scaling, and management of containerized applications. It provides several benefits for deploying LLMs, including:

  • Scalability: Kubernetes allows you to scale your LLM deployment horizontally by adding or removing compute resources as needed, ensuring optimal resource utilization and performance.
  • Resource Management: Kubernetes enables efficient resource allocation and isolation, ensuring that your LLM deployment has access to the required compute, memory, and GPU resources.
  • High Availability: Kubernetes provides built-in mechanisms for self-healing, automatic rollouts, and rollbacks, ensuring that your LLM deployment remains highly available and resilient to failures.
  • Portability: Containerized LLM deployments can be easily moved between different environments, such as on-premises data centers or cloud platforms, without the need for extensive reconfiguration.
  • Ecosystem and Community Support: Kubernetes has a large and active community, providing a wealth of tools, libraries, and resources for deploying and managing complex applications like LLMs.

Preparing for LLM Deployment on Kubernetes:

Before deploying an LLM on Kubernetes, there are several prerequisites to consider:

  1. Kubernetes Cluster: You'll need a Kubernetes cluster set up and running, either on-premises or on a cloud platform like Amazon Elastic Kubernetes Service (EKS), Google Kubernetes Engine (GKE), or Azure Kubernetes Service (AKS).
  2. GPU Support: LLMs are computationally intensive and often require GPU acceleration for efficient inference. Ensure that your Kubernetes cluster has access to GPU resources, either through physical GPUs or cloud-based GPU instances.
  3. Container Registry: You'll need a container registry to store your LLM Docker images. Popular options include Docker Hub, Amazon Elastic Container Registry (ECR), Google Container Registry (GCR), or Azure Container Registry (ACR).
  4. LLM Model Files: Obtain the pre-trained LLM model files (weights, configuration, and tokenizer) from the respective source or train your own model.
  5. Containerization: Containerize your LLM application using Docker or a similar container runtime. This involves creating a Dockerfile that packages your LLM code, dependencies, and model files into a Docker image.

Deploying an LLM on Kubernetes

Once you have the prerequisites in place, you can proceed with deploying your LLM on Kubernetes. The deployment process typically involves the following steps:

Building the Docker Image

Build the Docker image for your LLM application using the provided Dockerfile and push it to your container registry.

Creating Kubernetes Resources

Define the Kubernetes resources required for your LLM deployment, such as Deployments, Services, ConfigMaps, and Secrets. These resources are typically defined using YAML or JSON manifests.

Configuring Resource Requirements

Specify the resource requirements for your LLM deployment, including CPU, memory, and GPU resources. This ensures that your deployment has access to the necessary compute resources for efficient inference.

Deploying to Kubernetes

Use the kubectl command-line tool or a Kubernetes management tool (e.g., Kubernetes Dashboard, Rancher, or Lens) to apply the Kubernetes manifests and deploy your LLM application.

Monitoring and Scaling

Monitor the performance and resource utilization of your LLM deployment using Kubernetes monitoring tools like Prometheus and Grafana. Adjust the resource allocation or scale your deployment as needed to meet the demand.

Example Deployment

Let's consider an example of deploying the GPT-3 language model on Kubernetes using a pre-built Docker image from Hugging Face. We'll assume that you have a Kubernetes cluster set up and configured with GPU support.

Pull the Docker Image:

docker pull huggingface/text-generation-inference:1.1.0

Create a Kubernetes Deployment:

Create a file named gpt3-deployment.yaml with the following content:

apiVersion: apps/v1
kind: Deployment
metadata:
name: gpt3-deployment
spec:
replicas: 1
selector:
matchLabels:
app: gpt3
template:
metadata:
labels:
app: gpt3
spec:
containers:
- name: gpt3
image: huggingface/text-generation-inference:1.1.0
resources:
limits:
nvidia.com/gpu: 1
env:
- name: MODEL_ID
value: gpt2
- name: NUM_SHARD
value: "1"
- name: PORT
value: "8080"
- name: QUANTIZE
value: bitsandbytes-nf4

This deployment specifies that we want to run one replica of the gpt3 container using the huggingface/text-generation-inference:1.1.0 Docker image. The deployment also sets the environment variables required for the container to load the GPT-3 model and configure the inference server.

Create a Kubernetes Service:

Create a file named gpt3-service.yaml with the following content:

apiVersion: v1
kind: Service
metadata:
name: gpt3-service
spec:
selector:
app: gpt3
ports:
- port: 80
targetPort: 8080
type: LoadBalancer

This service exposes the gpt3 deployment on port 80 and creates a LoadBalancer type service to make the inference server accessible from outside the Kubernetes cluster.

Deploy to Kubernetes:

Apply the Kubernetes manifests using the kubectl command:

kubectl apply -f gpt3-deployment.yaml
kubectl apply -f gpt3-service.yaml

Monitor the Deployment:

Monitor the deployment progress using the following commands:

kubectl get pods
kubectl logs <pod_name>

Once the pod is running and the logs indicate that the model is loaded and ready, you can obtain the external IP address of the LoadBalancer service:

kubectl get service gpt3-service

Test the Deployment:

You can now send requests to the inference server using the external IP address and port obtained from the previous step. For example, using curl:

curl -X POST \
http://<external_ip>:80/generate \
-H 'Content-Type: application/json' \
-d '{"inputs": "The quick brown fox", "parameters": {"max_new_tokens": 50}}'

This command sends a text generation request to the GPT-3 inference server, asking it to continue the prompt “The quick brown fox” for up to 50 additional tokens.

Advanced topics you should be aware of

Kubernetes logo LLM GPU

While the example above demonstrates a basic deployment of an LLM on Kubernetes, there are several advanced topics and considerations to explore:

1. Autoscaling

Kubernetes supports horizontal and vertical autoscaling, which can be beneficial for LLM deployments due to their variable computational demands. Horizontal autoscaling allows you to automatically scale the number of replicas (pods) based on metrics like CPU or memory utilization. Vertical autoscaling, on the other hand, allows you to dynamically adjust the resource requests and limits for your containers.

To enable autoscaling, you can use the Kubernetes Horizontal Pod Autoscaler (HPA) and Vertical Pod Autoscaler (VPA). These components monitor your deployment and automatically scale resources based on predefined rules and thresholds.

2. GPU Scheduling and Sharing

In scenarios where multiple LLM deployments or other GPU-intensive workloads are running on the same Kubernetes cluster, efficient GPU scheduling and sharing become crucial. Kubernetes provides several mechanisms to ensure fair and efficient GPU utilization, such as GPU device plugins, node selectors, and resource limits.

You can also leverage advanced GPU scheduling techniques like NVIDIA Multi-Instance GPU (MIG) or AMD Memory Pool Remapping (MPR) to virtualize GPUs and share them among multiple workloads.

3. Model Parallelism and Sharding

Some LLMs, particularly those with billions or trillions of parameters, may not fit entirely into the memory of a single GPU or even a single node. In such cases, you can employ model parallelism and sharding techniques to distribute the model across multiple GPUs or nodes.

Model parallelism involves splitting the model architecture into different components (e.g., encoder, decoder) and distributing them across multiple devices. Sharding, on the other hand, involves partitioning the model parameters and distributing them across multiple devices or nodes.

Kubernetes provides mechanisms like StatefulSets and Custom Resource Definitions (CRDs) to manage and orchestrate distributed LLM deployments with model parallelism and sharding.

4. Fine-tuning and Continuous Learning

In many cases, pre-trained LLMs may need to be fine-tuned or continuously trained on domain-specific data to improve their performance for specific tasks or domains. Kubernetes can facilitate this process by providing a scalable and resilient platform for running fine-tuning or continuous learning workloads.

You can leverage Kubernetes batch processing frameworks like Apache Spark or Kubeflow to run distributed fine-tuning or training jobs on your LLM models. Additionally, you can integrate your fine-tuned or continuously trained models with your inference deployments using Kubernetes mechanisms like rolling updates or blue/green deployments.

5. Monitoring and Observability

Monitoring and observability are crucial aspects of any production deployment, including LLM deployments on Kubernetes. Kubernetes provides built-in monitoring solutions like Prometheus and integrations with popular observability platforms like Grafana, Elasticsearch, and Jaeger.

You can monitor various metrics related to your LLM deployments, such as CPU and memory utilization, GPU usage, inference latency, and throughput. Additionally, you can collect and analyze application-level logs and traces to gain insights into the behavior and performance of your LLM models.

6. Security and Compliance

Depending on your use case and the sensitivity of the data involved, you may need to consider security and compliance aspects when deploying LLMs on Kubernetes. Kubernetes provides several features and integrations to enhance security, such as network policies, role-based access control (RBAC), secrets management, and integration with external security solutions like HashiCorp Vault or AWS Secrets Manager.

Additionally, if you're deploying LLMs in regulated industries or handling sensitive data, you may need to ensure compliance with relevant standards and regulations, such as GDPR, HIPAA, or PCI-DSS.

7. Multi-Cloud and Hybrid Deployments

While this blog post focuses on deploying LLMs on a single Kubernetes cluster, you may need to consider multi-cloud or hybrid deployments in some scenarios. Kubernetes provides a consistent platform for deploying and managing applications across different cloud providers and on-premises data centers.

You can leverage Kubernetes federation or multi-cluster management tools like KubeFed or GKE Hub to manage and orchestrate LLM deployments across multiple Kubernetes clusters spanning different cloud providers or hybrid environments.

These advanced topics highlight the flexibility and scalability of Kubernetes for deploying and managing LLMs.

Conclusion

Deploying Large Language Models (LLMs) on Kubernetes offers numerous benefits, including scalability, resource management, high availability, and portability. By following the steps outlined in this technical blog, you can containerize your LLM application, define the necessary Kubernetes resources, and deploy it to a Kubernetes cluster.

However, deploying LLMs on Kubernetes is just the first step. As your application grows and your requirements evolve, you may need to explore advanced topics such as autoscaling, GPU scheduling, model parallelism, fine-tuning, monitoring, security, and multi-cloud deployments.

Kubernetes provides a robust and extensible platform for deploying and managing LLMs, enabling you to build reliable, scalable, and secure applications.

Carl Rost is the mind behind the AI-powered patent search tools at Patsnap.

Patsnap stands at the forefront of innovation intelligence, harnessing the power of AI and machine learning to sift through billions of datasets, enabling innovators to make crucial connections. Their cutting-edge LLM technology, tailored for R&D and IP professionals, effortlessly navigates through billions of pages of patents daily. Patsnap’s AI assistant engages in conversational responses to novelty questions and can pinpoint specific answers within extensive texts. For instance, it can accurately determine whether a particular widget type is already patented.

Can you provide an overview of how Patsnap's AI assistant works and its primary functions?

Sure! It’s an AI assistant called Hiro that allows you to ask questions about a specific patent or even a result set or our entire database! It’s been trained to understand innovation and patent related questions and respond in a way that satisfies technical subject matter experts and IP professionals. A recent advancement is that Hiro can even help you solve technical problems and propose novel directions for new inventions by applying inventive principles to technical solutions and problems that have been found in our patent and literature database. Hiro works a bit differently depending if you use it in our products that are for R&D or for IP professionals.

I think what makes Hiro unique is that it’s powered by Patsnap’s proprietary LLM, answers also link references and sources from Patsnap’s library of 200 million patents, 190 million pieces of literature, 254 million chemical structures, 879 million biological sequences, and 2 billion news articles.

What problems is this application solving for enterprises?

Great innovators should spend their time innovating, not determining novelty of products or doing preliminary research of the market. Patent data is one of our richest sources of technical information, rivaling journal data, especially in certain technology fields. For R&D, the time it takes to find and interrogate this type of data has been a massive blocker to leverage this, but tools like Hiro can truly democratize this type of information for the first time.

For legal professionals, it's common to spend hours, days, weeks, running prior art and freedom to operate searches. With AI tools this can be done more quickly, and with more accuracy, freeing up bandwidth for more strategic work.

Existing AI tools are one of two things: overly generalized and therefore not appropriate for the intellectual property space, or they are black boxes, with no transparency as to resources, reducing confidence and obstructing decision-making. With Hiro, we link back to sources and ensure full visibility at all stages of the development process.

What were the main challenges your team faced while developing the AI features for Patsnap, and how did you overcome them?

We know that individuals building new inventions want to keep them protected, so security was top of mind when building Hiro. As the model powering Hiro is local and built into our app, no data leaves the environment to third parties that are hard to trust. Our competitors didn’t do the groundwork and bolted on third party models that don’t stand up to scrutiny. When we say that we aren’t training models on customer data, we know that to be true and can show our customers that and what we do instead. In contrast, our competitors' solutions expose you to risk through third parties who have a less than stellar reputation, in terms of transparency and handling of data.

Could you elaborate on how Hiro answers specific novelty questions and the impact this has on R&D and IP workflows?

With Hiro, users can ask questions like “What aspects of this invention make it novel?” or “How might this patent hold up in different legal systems?” or even “how to build a wearable jetpack” and get answers that speak to each step of the invention process. Compared to generalist models, Hiro really gets what makes a patent special. Users don’t need to be patent experts to get to the bottom of what is or isn’t novel within their invention, and can understand in seconds which part of their product or tool needs to be protected.

How does Hiro handle the vast amount of data from patents and non-patent literature to provide precise and relevant answers?

We did extensive training on that dataset, and rated the responses with experts. We then trained AI on the expert responses, had the AI rate output, and had experts review that. All in all, we’ve rated millions of data points this way to ensure the responses are meaningful for tech experts and patent pros.

How does Hiro utilize large language models (LLMs) to enhance the efficiency of patent searches and IP analysis? What types of data were used to train Patsnap's proprietary LLM, and how do you ensure its accuracy and reliability?

Patsnap built an industry-specific LLM to power Hiro. The LLM has been trained on patent records, academic papers, and other innovation data, which helps it understand and retell info in a way that is more helpful to professionals than generalist models. To ensure accuracy and reliability, we employed rigorous data preprocessing methods, including filtering out lowquality data, deduplication, and rewriting. We also synthesized new data by combining different sources to enhance the model's understanding of IP-specific nuances. We supervised finetuning and reinforcement learning from human feedback to continually improve its performance.

PatsnapGPT has been tested extensively and has outperformed GPT-4 in IP-specific tasks, demonstrating superior capabilities in drafting, classifying, summarizing, and reasoning within the patent domain.

The proprietary LLM is transparent, linking sources and references, and it’s not trained on customer data. It’s the only industry player using an in-house tuned LLM, in an industry that is especially reliant on data privacy and confidentiality.

How does Patsnap’s proprietary LLM compare to other general-purpose LLMs like GPT-4 in terms of performance and accuracy for IP-related tasks?

Patsnap’s proprietary LLM outperforms GPT-4 when it comes to intellectual property queries. Using the USPTO Patent Bar Exam, PatsnapGPT-1.0’s performed at the level of an IP expert, while general LLMs did not reach the cutoff for patent lawyers taking the exam.

PatsnapGPT really stands out when you look at how it performs in IP-specific benchmarks.  Hiro consistently scores higher than general models like GPT-4 on the USPTO Patent Bar Exam.  General LLMs fail to pass the 70-point cutoff on the exam, while PatsnapGPT 1.0 scored at the level of an IP expert. This shows it has a better grasp of IP fundamentals. Additionally, in the PatentBench, which is a comprehensive benchmark for IP tasks, PatsnapGPT excelled in several areas. It produced more accurate and relevant texts for patent writing, scored higher in classifying patents according to the International Patent Classification system, and its summaries of technical effects, problems, methods, and abstracts were consistently rated higher by evaluators. It also shows faster speeds and lower memory usage compared to GPT-4 for long patent documents.

How do you envision the role of AI evolving in the field of intellectual property and research and development over the next decade?

I see AI playing an increasingly central role in intellectual property and research and development over the next decade. For one, AI will greatly enhance the efficiency and accuracy of patent searches and analysis. Advanced AI models like PatsnapGPT will become even better at understanding and categorizing complex technical documents, drafting high quality patent specifications, and identifying potential infringements or overlaps in existing patents. This will save a tremendous amount of time and reduce the margin for human error.

Moreover, AI will revolutionize how we handle and interpret vast amounts of IP data. With the ability to process and analyze large datasets quickly, AI can uncover trends and insights that might otherwise go unnoticed. This can inform better decision-making and strategy in IP management and R&D, such as identifying emerging technologies, potential areas for innovation, and strategic partnerships.

In R&D, AI will drive innovation by aiding in the discovery process. Machine learning algorithms can analyze previous research, predict outcomes, and even suggest new lines of inquiry, accelerating the pace of discovery and development. AI can also simulate experiments and model complex systems, reducing the need for costly and time-consuming physical trials.

As AI technology continues to evolve, its integration into IP and R&D will enhance creativity, efficiency, and strategic planning.

Thank you for the great interview, readers who wish to learn more should visit Patsnap

AI adoption is reaching a critical inflection point. Businesses are enthusiastically embracing AI, driven by its promise to achieve order-of-magnitude improvements in operational efficiencies.

A recent Slack Survey found that AI adoption continues to accelerate, with use of AI in workplaces experiencing a recent 24% increase and 96% of surveyed executives believing that “it’s urgent to integrate AI across their business operations.”

However, there is a widening divide between the utility of AI and the growing anxiety about its potential adverse impacts. Only 7%of desk workers believe that outputs from AI are trustworthy enough to assist them in work-related tasks.

This gap is evident in the stark contrast between executives’ enthusiasm for AI integration and employees’ skepticism related to factors such as:

The Role of Legislation in Building Trust

To address these multifaceted trust issues, legislative measures are increasingly being seen as a necessary step. Legislation can play a pivotal role in regulating AI development and deployment, thus enhancing trust. Key legislative approaches include:

  • Data Protection and Privacy Laws: Implementing stringent data protection laws ensures that AI systems handle personal data responsibly. Regulations like the General Data Protection Regulation (GDPR) in the European Union set a precedent by mandating transparency, data minimization, and user consent.  In particular, Article 22 of GDPR protects data subjects from the potential adverse impacts of automated decision making.  Recent Court of Justice of the European Union (CJEU) decisions affirm a person’s rights not to be subjected to automated decision making.  In the case of Schufa Holding AG, where a German resident was turned down for a bank loan on the basis of an automated credit decisioning system, the court held that Article 22 requires organizations to implement measures to safeguard privacy rights relating to the use of AI technologies.
  • AI Regulations: The European Union has ratified the EU AI Act (EU AIA), which aims to regulate the use of AI systems based on their risk levels. The Act includes mandatory requirements for high-risk AI systems, encompassing areas like data quality, documentation, transparency, and human oversight.  One of the primary benefits of AI regulations is the promotion of transparency and explainability of AI systems. Furthermore, the EU AIA establishes clear accountability frameworks, ensuring that developers, operators, and even users of AI systems are responsible for their actions and the outcomes of AI deployment. This includes mechanisms for redress if an AI system causes harm. When individuals and organizations are held accountable, it builds confidence that AI systems are managed responsibly.

Standards Initiatives to foster a culture of trustworthy AI

Companies don’t need to wait for new laws to be executed to establish whether their processes are within ethical and trustworthy guidelines. AI regulations work in tandem with emerging AI standards initiatives that empower organizations to implement responsible AI governance and best practices during the entire life cycle of AI systems, encompassing design, implementation, deployment, and eventually decommissioning.

The National Institute of Standards and Technology (NIST) in the United States has developed an AI Risk Management Framework to guide organizations in managing AI-related risks. The framework is structured around four core functions:

  • Understanding the AI system and the context in which it operates. This includes defining the purpose, stakeholders, and potential impacts of the AI system.
  • Quantifying the risks associated with the AI system, including technical and non-technical aspects. This involves evaluating the system’s performance, reliability, and potential biases.
  • Implementing strategies to mitigate identified risks. This includes developing policies, procedures, and controls to ensure the AI system operates within acceptable risk levels.
  • Establishing governance structures and accountability mechanisms to oversee the AI system and its risk management processes. This involves regular reviews and updates to the risk management strategy.

In response to advances in generative AI technologies NIST also published Artificial Intelligence Risk Management Framework: Generative Artificial Intelligence Profile, which provides guidance for mitigating specific risks associated with Foundational Models.  Such measures span guarding against nefarious uses (e.g. disinformation, degrading content, hate speech), and ethical applications of AI that focus on human values of fairness, privacy, information security, intellectual property and sustainability.

Furthermore, the International Organization for Standardization (ISO) and the International Electrotechnical Commission (IEC) have jointly developed ISO/IEC 23894, a comprehensive standard for AI risk management. This standard provides a systematic approach to identifying and managing risks throughout the AI lifecycle including risk identification, assessment of risk severity, treatment to mitigate or avoid it, and continuous monitoring and review.

The Future of AI and Public Trust

Looking ahead, the future of AI and public trust will likely hinge on several key factors which are essential for all organizations to follow:

  • Performing a comprehensive risk assessment to identify potential compliance issues. Evaluate the ethical implications and potential biases in your AI systems.
  • Establishing a cross-functional team including legal, compliance, IT, and data science professionals. This team should be responsible for monitoring regulatory changes and ensuring that your AI systems adhere to new regulations.
  • Implementing a governance structure that includes policies, procedures, and roles for managing AI initiatives. Ensure transparency in AI operations and decision-making processes.
  • Conducting regular internal audits to ensure compliance with AI regulations. Use monitoring tools to keep track of AI system performance and adherence to regulatory standards.
  • Educating employees about AI ethics, regulatory requirements, and best practices. Provide ongoing training sessions to keep staff informed about changes in AI regulations and compliance strategies.
  • Maintaining detailed records of AI development processes, data usage, and decision-making criteria. Prepare to generate reports that can be submitted to regulators if required.
  • Building relationships with regulatory bodies and participate in public consultations. Provide feedback on proposed regulations and seek clarifications when necessary.

Contextualize AI to achieve Trustworthy AI

Ultimately, trustworthy AI hinges on the integrity of data.  Generative AI’s dependence on large data sets does not equate to accuracy and reliability of outputs; if anything, it’s counterintuitive to both standards. Retrieval Augmented Generation (RAG) is an innovative technique that “combines static LLMs with context-specific data. And it can be thought of as a highly knowledgeable aide. One that matches query context with specific data from a comprehensive knowledge base.”  RAG enables organizations to deliver context specific applications that adheres to privacy, security, accuracy and reliability expectations.  RAG improves the accuracy of generated responses by retrieving relevant information from a knowledge base or document repository. This allows the model to base its generation on accurate and up-to-date information.

RAG empowers organizations to build purpose-built AI applications that are highly accurate, context-aware, and adaptable in order to improve decision-making, enhance customer experiences, streamline operations, and achieve significant competitive advantages.

Bridging the AI trust gap involves ensuring transparency, accountability, and ethical usage of AI. While there’s no single answer to maintaining these standards, businesses do have strategies and tools at their disposal. Implementing robust data privacy measures and adhering to regulatory standards builds user confidence. Regularly auditing AI systems for bias and inaccuracies ensures fairness. Augmenting Large Language Models (LLMs) with purpose-built AI delivers trust by incorporating proprietary knowledge bases and data sources. Engaging stakeholders about the capabilities and limitations of AI also fosters confidence and acceptance

Trustworthy AI is not easily achieved, but it is a vital commitment to our future.

Artificial Intelligence (AI) is increasingly becoming the foundation of modern manufacturing with unprecedented efficiency and innovation. Imagine production lines that adjust themselves in real time, machinery that predicts its own maintenance needs, and systems that streamline every aspect of the supply chain. This is not any futuristic anticipation. Rather, it is happening now, driven by AI technologies reshaping the manufacturing domain.

However, integrating AI into manufacturing presents several challenges. Two of the most significant challenges are the availability of high-quality data and the need for more skilled talent. Even the most advanced AI models can fail without accurate and comprehensive data. Additionally, deploying and maintaining AI systems requires a workforce skilled in both manufacturing and AI technologies.

Why are these challenges so crucial? The implications are significant. Manufacturers that overcome these barriers can gain a substantial competitive edge. They can expect increased productivity, substantial cost reductions, and enhanced innovation. Conversely, those who fail to address these challenges may stay caught up in an increasingly competitive market, facing missed opportunities, inefficiencies, and operational obstructions.

Data Deluge in Manufacturing

The manufacturing industry is experiencing a data revolution driven by the information flood from sensors, IoT devices, and interconnected machinery. This data provides insights into production processes, from equipment performance to product quality. However, managing this vast influx of data is a major challenge. The huge volume strains storage capacities and complicates processing and analysis efforts, often overwhelming traditional systems.

Even with an abundance of data, maintaining its quality is essential. High-quality data, characterized by accuracy, consistency, and relevance, is necessary for AI models to make reliable predictions and decisions. Unfortunately, many manufacturers face issues with data that is incomplete, inconsistent, or noisy, which undermines the effectiveness of their AI applications. The saying “garbage in, garbage out” is true for AI. Without clean and reliable data, even advanced AI systems can fail.

Additionally, data silos present another challenge. Manufacturing data is often fragmented across various departments and legacy systems, making obtaining a comprehensive view of operations difficult. This fragmentation hinders effective AI implementation. Bridging these silos to create a unified data environment requires significant effort and investment, often requiring overhauls of existing IT infrastructure and processes.

Furthermore, as manufacturing systems become more interconnected, ensuring data privacy and security is increasingly critical. The rise of cyber threats poses substantial risks to sensitive production data, potentially leading to severe operational disruptions. Therefore, balancing data accessibility with robust security measures is essential. Manufacturers must adopt strict cybersecurity practices to protect their data while adhering to regulatory requirements, maintaining trust, and safeguarding their operations.

Data Quality and Preprocessing

The effectiveness of AI applications in manufacturing heavily depends on the quality of the data fed into the models. One of the foundational tasks in preparing data is data cleaning and standardization. Cleaning involves removing inaccuracies, handling missing values, and eliminating inconsistencies that can skew results. Standardization ensures that data from various sources is uniform and compatible, allowing seamless integration and analysis across different systems.

Another critical aspect is feature engineering, which transforms raw data into meaningful features that enhance the performance of AI models. This process involves selecting relevant variables, modifying them to highlight important patterns, or creating new features that provide valuable insights. Effective feature engineering can significantly boost the predictive power of AI models, making them more accurate and reliable.

Anomaly detection is also essential for maintaining data quality. By identifying outliers and unusual patterns, manufacturers can address potential unnoticed errors or issues. Anomalies can indicate problems in the data collection process or reveal important trends that require further investigation, ensuring the reliability and accuracy of AI predictions.

Data labeling plays a vital role, especially for supervised learning models that require labeled examples to learn from. This process involves annotating data with relevant tags or labels, which can be time-consuming but essential for effectively training AI models. Labeled data provides the necessary context for AI systems to understand and predict outcomes accurately, making it a cornerstone of effective AI deployment.

Talent Shortage in Manufacturing AI

The adoption of AI in manufacturing faces significant hurdles due to a shortage of skilled professionals. Finding experts with a deep understanding of AI and practical knowledge of manufacturing processes is challenging. Many manufacturers struggle to recruit talent with the necessary skills in AI, machine learning, and data science, creating a skills gap that slows down AI implementation.

Key roles in manufacturing AI include data scientists, machine learning engineers, and domain specialists. Data scientists analyze and interpret complex data; machine learning engineers develop and deploy AI models, and domain specialists ensure AI solutions are relevant to manufacturing challenges. The combination of these roles is vital for successful AI integration.

However, competition for this talent is intense, especially from large tech companies that offer attractive salaries and benefits. This makes it difficult for smaller manufacturing firms to attract and retain skilled professionals.

Strategies for Overcoming Talent Barriers

Addressing the AI talent gap in manufacturing requires a multifaceted approach. One effective strategy is to invest in upskilling the existing workforce. Manufacturers can equip their employees with essential skills by offering training programs, workshops, and certifications in AI and related technologies. Providing opportunities for continuous learning and professional development also helps retain talent and fosters a culture of continuous improvement.

Collaborations with academic institutions are imperative in bridging the gap between industry and education. Manufacturers can partner with universities to design AI-specific curricula, offer internships, and engage in joint research projects. These partnerships provide students with practical experience, create a pipeline of skilled professionals, and promote innovation through collaborative research.

Benefitting from external expertise is another effective strategy. Outsourcing AI projects to specialized firms and utilizing external experts can provide access to advanced technologies and skilled professionals without extensive in-house expertise.

Crowdsourcing talent through platforms like Kaggle allows manufacturers to solve specific AI challenges and gain insights from a global pool of data scientists and machine learning experts. Collaborating with AI consultancies and technology providers helps manufacturers implement AI solutions efficiently, allowing them to focus on their core competencies.

AI in Manufacturing Real-world Examples

Several leading manufacturing companies are benefitting from AI. For example, General Electric (GE) has successfully implemented AI-driven predictive maintenance, analyzing sensor data from equipment to predict potential failures before they occur. This proactive approach has significantly reduced equipment downtime and maintenance costs, improving operational efficiency and extending machinery lifespan.

Similarly, Bosch used AI for demand forecasting, inventory management, and quality control. By optimizing inventory levels, Bosch reduced costs and improved order fulfillment. Quality control has also seen significant advancements through AI. Likewise, Siemens employed AI-powered computer vision systems for real-time quality control in its assembly lines. This technology detects defects immediately, ensuring consistent product quality and reducing waste, leading to a 15% increase in production efficiency.

The Bottom Line

In conclusion, integrating AI in manufacturing transforms the industry, turning futuristic concepts into present-day realities. Overcoming data and talent barriers is important for fully utilizing AI’s transformative potential. Manufacturers who invest in high-quality data practices, upskill their workforce, and collaborate with academic institutions and external experts can achieve unmatched efficiency, innovation, and competitiveness. Embracing AI technology enables manufacturers to drive productivity and operational excellence, paving the way for a new era in manufacturing.

First and foremost, it should go without saying that any AI solution should strive for the highest level of accuracy possible as to provide the right outputs needed for all inputs. But creating a great experience with AI goes beyond just providing the correct information to end-users; it also includes enabling the correct delivery of that information to them, which takes a decent amount of creativity to execute successfully. For instance, in a customer service interaction, an AI-driven communications solution should be able to automatically match the tone of the customer and adjust as needed in real time, giving them exactly what they need in the way that will best reach them at that moment. The AI should also communicate in a life-like manner to make customers feel more comfortable, but not so much as to deceive them into thinking they’re speaking to a human when they’re not. Again, it all goes back to fostering trust in AI, which will eventually lead to even more widespread adoption and use of the technology.

What role does data play in ensuring the accuracy of AI responses, and how do you manage data to optimize AI performance?

Good data creates good AI. In other words, the quality of the data that’s fed into an AI model correlates directly with the quality of the information that model produces. In customer service, customer interaction data is the key to finding gaps in the customer journey. By digging deeper into this data, organizations can begin to better understand customer intents and then use that information to streamline and improve AI-driven engagement, transforming the overall customer journey and experience. But organizations must have the right data architectures in place to both process and extract insights from the massive amounts of data associated with AI solutions.

The IntelePeer AI solution uses the content and context of the interaction to determine the best course of action at every turn. During an interaction, if a question is posed by the customer that requires an answer specific to a business’s process, rules, or policies, the AI workflow automatically leverages a knowledge base that includes such business data as FAQ documents, agent training materials, website data, policy, and other business information to respond accordingly. Similarly, if a question or a request is made that the business does not want AI to respond to directly, the AI workflow will escalate the query to a human agent if required. The remaining interaction can be automatically added to the Q&A pairs to enhance responses in subsequent customer interactions or handed off to a supervisory authority for approval prior to incorporation.

With AI's increasing role in customer support, how do you foresee the role of frontline agents evolving?

We at IntelePeer envision a drastic reduction in the reliance on frontline agents due to the evolution of AI technologies. With massive strides in AI-driven call containment, which continues to improve in quality and grow in volume, organizations today are able to automate up to 90% of their customer interactions. This allows them to optimize their frontline staffing and save significantly on operational costs—all while providing better experiences for the customers they serve.

While some tasks are automated, which skilled CX roles do you believe will remain critical despite AI advancements?

While AI will cut down on the number of frontline agents needed in customer service roles, a human element will always be needed in CX operations. For example, AI-powered communications models must be trained, configured, and managed with human oversight to ensure accuracy and the elimination of any biases. The human touch is also needed to align automated customer communications with the messaging and personality of the organization or brand they’re coming from, which contributes to customer comfortability and helps to foster trust in the technology. These more technical, AI-oriented roles will overtake typical frontline roles in the years to come.

AI hallucinations are a concern in maintaining accurate customer interactions. What specific guardrails has IntelePeer implemented to prevent AI from fabricating facts?

 Businesses need to implement generative AI today to stay relevant amid the ongoing revolution while avoiding a rushed and disastrous rollout. In order to do that responsibly, companies must start with implementing a Retrieval Augmented Generation (RAG) pattern to help their gen AI interface with analyzing large enterprise datasets. For automated customer service interactions, brands must create a human feedback loop to analyze past interactions and improve the quality of those datasets used for fine-tuning and retrieval augmentation. Further, in order to eliminate AI hallucinations, organizations should be laser focused on:

  • implementing guardrails by analyzing customer interaction data and developing comprehensive, dynamic knowledge bases;
  • investing in continuous monitoring and updating of these systems to adapt to new queries and maintain accuracy; and
  • training staff to recognize and manage unidentifiable permutations ensures seamless escalation and resolution processes.

How do you ensure that large language models (LLMs) interpret context correctly and provide reliable responses?

 A haphazard approach to implementing gen AI can result in output quality issues, hallucinations, copyright infringement, and biased algorithms. Therefore, businesses need to have response guardrails when applying gen AI in the customer service environment. IntelePeer utilizes retrieval augmented generation (RAG), which feeds data context to an LLM to get responses grounded in a customer-provided dataset. Throughout the entire process, from the moment the data gets prepared until the LLM sends a response to the client, the necessary guardrails prevent any sensitive information from being exposed. IntelePeer’s RAG begins when a customer asks a question to an AI-powered bot. The bot performs a lookup of the question in the knowledge base. If it cannot find an answer, it will transfer to an agent and save the question to the Q&A database. Later, a human will review this new question, conduct a dataset import, and save the answer to the knowledge base. Ultimately, no question goes unanswered. With the RAG process in place, businesses can maintain control over response sets for interaction automation.

Looking ahead, what trends do you anticipate in AI's role in customer experience?

At IntelePeer, we deeply believe that generative AI is a powerful tool that will positively augment human communication capabilities, unlocking new opportunities and overcoming long standing barriers. AI will continue enhancing customer service communications by streamlining customer service interactions, offering around-the-clock assistance and providing language-bridging capabilities. Moreover, trained on large language models (LLMs), virtual assistants will be able draw upon millions of human conversations to quickly detect emotions to modify its tone, sentiment and word choice. There will be more and more evidence that businesses that successfully use AI to enhance human connections experience see a significant return on investment and improved efficiency and productivity.

Thank you for the great interview, readers who wish to learn more should visit IntelePeer.
